Before we get into how to build, we need to understand why so many projects fail. A post-mortem analysis of hundreds of failed AI implementations around the world points to three recurring cardinal sins.
The first and most common is to start with the technology, not the business problem. Teams, fascinated by the possibilities of a new language model or image recognition algorithm, ask the question, “Where could we use this cool technology?” It’s a reversal of the order. Mature organizations start with the question: “What is our costliest, most persistent business problem that we could solve if we had unlimited analytics capabilities?”. Only a problem with a clearly defined business value (e.g., reducing customer churn by 15%, reducing query response time by 50%) can justify a significant investment in AI.
The second sin is a fundamental misunderstanding of the role and nature of data. Many companies assume that since they “have the data,” they are ready for AI. In reality, data in its raw form is almost always chaotic, incomplete and full of errors. The process of acquiring, cleaning, structuring and labeling them is the most difficult, longest and costly phase of any AI project, often consuming up to 80% of the total time and budget.
The third mistake, already mentioned, is treating AI like a standard IT project. Leaders expect predictable schedules and guaranteed results. Meanwhile, AI development is more like working in a research lab. We set up a hypothesis, conduct an experiment (train a model) and analyze the results. Sometimes the experiment fails and we have to try another method. Success requires a change in thinking - from an “implementation” mentality to a “discovery” mentality.
How do you define a business problem that is an ideal candidate for AI to solve?
A good AI project starts with finding the ideal “point of contact” between a real business need and the technology’s capabilities. Not every problem is suitable for AI to solve. Identifying those best candidates is a key strategic skill. At ARDURA Consulting, we use a simple but effective three-step filter to do this.
First, we assess **the value of the potential solution **. What measurable benefit will the success of the project bring to the company? Will it be a direct increase in revenue (e.g., through better product recommendations), a significant reduction in costs (e.g., through process automation), or perhaps improved customer satisfaction and retention? A problem without a clearly defined and significant potential return on investment (ROI) should not be considered.
Second, we analyze feasibility from a data perspective. This is a brutally honest question: do we have access to enough historical, high-quality data that describes the problem we want to solve? If we want to predict machine failures, we must have detailed data on previous failures. If we don’t have the data, or it’s of abysmal quality, the project is unworkable until we have a strategy in place to acquire it.
Third, we evaluate the complexity and definition of the problem itself. The best candidates are tasks that are repeatable, pattern-based and well-defined. “Classifying incoming customer emails” is a good problem. “Improving marketing” is too general a goal. Artificial intelligence needs clear rules of the game and a precisely defined task to perform.
How to build and manage the most important asset in a project?
A famous saying in the AI world is, “A machine learning model is only as good as the data it is trained on.” You can have the world’s best data scientists and most powerful computers, but if you feed them junk data, you will get junk and useless results at the output. This is the principle of “Garbage In, Garbage Out” in its purest form.
Therefore, the data management process is the absolute heart of any AI project. It begins with the acquisition and integration of data, which is often scattered across dozens of different systems in the company. Then comes the most difficult stage: **data preparatio **. This is the tedious work of cleaning them (removing errors and duplicates), filling in missing values, normalizing and, often crucial, labeling. If we want to teach the model to recognize cat images, we must first provide it with thousands of images with the “cat” label manually added. This process is extremely time-consuming and requires great precision.
Data governance and ethics is an equally important aspect, especially in 2025. We need to ensure that the process of collecting and using data is fully compliant with regulations such as GDPR. Moreover, we need to proactively analyze our data sets for potential bias. If the historical data on which we train a credit scoring model reflects historical discrimination against certain social groups, our “objective” AI model will learn and automate that discrimination.
What is the process of selecting and training machine learning algorithms?
Once we have prepared, clean data, we can proceed to the heart of the project - building and training the model. To outsiders, this stage often seems like black magic. In reality, it is a structured process that can be compared to teaching a very capable but initially completely empty “student.”
The first step is to choose the right “learning method, ” or family of algorithms. If we have historical data with correct answers (e.g., pictures with labels), we use Supervised Learning, which is like learning from a textbook with answers. If we want the algorithm to find hidden patterns and structures in the data on its own (e.g., group customers into segments), we use Unsupervised Learning. For the most complex tasks, such as natural language understanding or image analysis, we use deep learning, based on complex neural networks inspired by the structure of the human brain.
The training process itself involves “showing” the model the training data. The model analyzes this data, tries to find patterns in it and creates its internal rules based on this. Then its knowledge is tested on a separate set of test data that it has never seen before - it’s like an exam for a student. This process is repeated many times, and the data scientist (Data Scientist), like a good teacher, adjusts the parameters of the model to get the best possible results on the “exam.”
Evaluation and iteration: How do we know that an AI model is “good enough” for implementation?
The key question after the coaching process is, “When is our model ready to start making real decisions in the business world?” The answer is never, “When it reaches 100% accuracy.” In complex problems this is virtually impossible. The answer is, “When its performance is better than the existing process and meets precisely defined metrics of success.”
The definition of these metrics is key and must be closely aligned with the business objective. Imagine a model to detect fraud transactions. In this case, mere “accuracy” (accuracy) is a useless metric. It is much more important for the model to have a high sensitivity (recall), that is, to catch as many real frauds as possible, even at the expense of sometimes mistakenly flagging a valid transaction (which will generate a so-called false alarm). In contrast, in a model that is supposed to diagnose diseases, precision (precision) may be a priority, to avoid false positive diagnoses.
The evaluation process is always iterative. The first trained model is rarely the final version. It is a starting point for further experimentation: with other algorithms, with new data or with a different architecture. Success in AI is born of a culture of rapid, disciplined experimentation and continuous improvement.
MLOps: Why is implementing and maintaining an AI system a whole different ballgame than in traditional IT?
Let’s assume that we have successfully trained and externalized a model that achieves great results. Many managers think at this point that the project is complete. This is one of the most dangerous mistakes. Implementing a model into production and maintaining it is a completely different, often more difficult challenge than the training process itself. This is what the field called MLOps (Machine Learning Operations) deals with.
The fundamental difference between traditional software and an AI system is that the code of a traditional application breaks down only when developers introduce an error in it. In contrast, an AI system can “break” on its own, even if no one touches its code. This is because the real world is constantly changing. New data that comes into the system may start to differ from the data on which the model was trained. This phenomenon is called model drift. A model that perfectly predicted customer behavior on the day of implementation may become useless or even harmful six months later, under changed market conditions.
MLOps is a set of practices and tools to prevent this. It’s like DevOps for machine learning. It includes building automated pipelines to continuously monitor model performance in production, automatically retry it on new data when a drop in quality is detected, and manage versions not only of the code, but also of the data and the models themselves. Without a solid MLOps strategy, any investment in AI is a short-term investment doomed to slow degradation.
What does the architecture of a modern AI system look like and what components are necessary for its operation?
A working AI system is much more than a mere file with a trained model. It’s a complex, distributed ecosystem with many components working together. Understanding this architecture at a high level is crucial for technology leaders to estimate the realistic scale and cost of implementation.
A typical modern AI system consists of several layers. At the very beginning is the data acquisition and storage layer, which can include Data Lakes for raw data and Data Warehouses for structured data. Then we have data processing pipelines (ETL/ELT), based on tools such as Apache Spark, which clean and prepare data for training.
The training of the models themselves is usually done in a dedicated, scalable environment, often using the processing power of graphics processing units (GPUs) in the cloud. The trained models are stored and versioned in the Model Registry.
A key component that other applications in the company communicate with is the API for serving predictions (Inference API). It is this component that accepts new data (e.g., about a new customer) and returns a prediction from the model in real time (e.g., “churn risk: 85%”). The whole thing is tied together by monitoring and logging systems that track both technical performance and the quality of the model’s prediction.
What are the biggest ethical and business risks associated with AI and how to protect against them?
As the power and autonomy of AI systems grows, so does the responsibility of companies to operate them. In 2025, ignoring ethical and regulatory aspects is not only irresponsible, but can lead to huge financial and reputational losses.
The biggest challenge is the risk of bias (bias). An AI model trained on historical data that reflects human biases will learn them and replicate them on a massive scale. This can lead to discrimination in recruitment processes, credit scoring or even medical diagnosis. Proactively auditing data and models for fairness is an absolute necessity.
